Abstract

Natural Language Processing (NLP) has experienced a profound transformation with the integration of Artificial Intelligence (AI), particularly deep learning and attention-based architectures. This review provides a comprehensive and structured overview of the evolution of NLP, tracing its progression from rule-based and statistical approaches to modern deep neural networks and Large Language Models (LLMs). We examine foundational architectures, including recurrent neural networks and their limitations, before detailing the transformative impact of the Transformer architecture and self-attention mechanisms that enabled large-scale parallelization and contextual modeling. The paper further explores pre-training paradigms such as BERT and GPT, highlighting their roles in transfer learning, few-shot learning, and the emergence of general-purpose language intelligence. Recent advances in scaling laws, instruction tuning, and parameter-efficient fine-tuning techniques including adapters, prefix tuning, and low-rank adaptation are critically reviewed as solutions to computational and deployment challenges. Emerging research directions are discussed with emphasis on multimodal large language models, domain-specific specialization, and architectural optimizations aimed at efficiency and generalization. Finally, the review addresses ethical challenges associated with LLMs, including bias, fairness, transparency, and governance, presenting current mitigation strategies and Responsible AI frameworks. By synthesizing architectural, methodological, and ethical perspectives, this review provides a unified reference for researchers and practitioners seeking to understand the current state, limitations, and future trajectories of AI-driven NLP systems.
